Kelly's first sign of trouble occurred in 1917 when he enrolled at Mississippi State University to study agriculture.
Kelly was considered a poor student from the start, with his highest grade (a C plus) awarded for good physical hygiene. He was constantly in trouble with the faculty and spent the majority of his academic career trying to work off the demerits he had accrued.
Kelly met a young woman named Geneva Ramsey during this time period. Kelly quickly fell in love with Geneva and abruptly dropped out of school to marry.

Kelly worked as a bootlegger for himself and a colleague during the Prohibition era of the 1920s and 1930s. After a short time and several run-ins with the Memphis police, he decided to leave town with his girlfriend and head west. He changed his name to George R. Kelly to protect his family and to avoid law enforcement officers.
He continued to commit minor offenses and engage in bootlegging. In 1928, he was arrested in Tulsa, Oklahoma, for smuggling liquor onto a Native American reservation, and he was sentenced to three years in Leavenworth Penitentiary in Kansas, beginning February 11, 1928. He was said to be a model inmate who was released early.
Shortly after, Kelly married Kathryn Thorne, an experienced criminal who purchased Kelly's first machine gun and insisted on him performing target practice in the countryside despite his lack of interest in weapons, and went to great lengths to familiarise his name within underground crime circles.
